## What Is an AI Agent?

An AI agent is a program that:
- **Perceives** its environment (user inputs, API responses, files)
- **Decides** on an action based on its internal logic (prompts, chain-of-thought, planner)

- **Learns/Remembers** by updating its context or memory store between steps

Such agents power applications like autonomous chatbots, data analysts, and code assistants.

## Key Components

1. **Language Model (LLM)**  
   Provides the reasoning and language generation capabilities (e.g., OpenAI's GPT-4)

2. **Prompt Template**  
   Defines how input and context are formatted for the LLM

3. **Tool Interface**  
   Python wrappers around APIs or local functions (e.g., search, calculator, file I/O)

4. **Memory/Context Store**  
   Persists conversation history or state (e.g., in Redis, SQLite, or in-memory)

5. **Agent Loop**  
   Orchestrates perception → decision → action steps until a termination condition

This code will:
- Load GPT-4 with a fixed prompt strategy (zero-shot-react-description)
- Wrap our Python functions so the LLM can call them as "tools"
- Execute a REACT-style loop: Reason → Act → Observe → Think

For multi-turn interactions, integrate a simple memory module.

Building Your First AI Agent: A Step-by-Step Guide

Multithreading is "the ability of a central processing unit (CPU) (or a single core in a multi-core processor) to provide multiple threads of execution concurrently, supported by the operating system." In situations where the work can be divided into smaller units, which can be run in parallel, without negative effects on data consistency, multithreading can be used to improve application performance.

In Kafka topics, records are grouped into smaller units—partitions, which can be processed independently without compromising the correctness of the results and lays the foundations for parallel processing. This is usually achieved by scaling: using multiple consumers within the same group, each processing data from a subset of topic partitions and running in a single thread.

## Thread per Consumer Model

For most use cases, reading and processing messages in a single thread is perfectly fine, so it's not surprising that thread per consumer threading model is commonly used with the Apache Kafka® consumer. When processing doesn't involve I/O operations, it's usually very fast, so the poll loop runs smoothly. While this model has many benefits, especially with regard to the simplicity of client code, it also has limitations that can cause problems in some use cases.

### Basic Implementation

A typical single-threaded implementation is centered around a poll loop:

    ConsumerRecords records = consumer.poll(Duration.ofMillis(10000));
    // Handle fetched records

```

### Offset Management

With the default configuration, the consumer automatically stores offsets to Kafka. The `auto.commit.interval.ms` config controls the frequency of commits. While users might assume that offsets are committed in these intervals by a background thread, in reality:

- Offsets are committed during the consumer's poll method execution
- `auto.commit.interval.ms` only defines the minimum delay between commits
- Only offsets of records returned in previous poll calls are committed
- Since processing happens between poll calls, offsets of unprocessed records will never be committed
- This guarantees at-least-once delivery semantics

### Group Rebalancing

Consumer group rebalancing is triggered when:
- A new consumer joins the group
- An existing consumer leaves the group
- An existing consumer changes subscription
- Partitions are added to one of the subscribed topics

## Multi-Threaded Consumer Model

### Motivation

While the thread-per-consumer model works well for many use cases, there are scenarios where a multi-threaded approach offers significant advantages:

1. **Slow Processing Issues**
   - The `max.poll.interval.ms` config (default: 5 minutes) defines the maximum delay between poll calls
   - If a consumer fails to call poll within this interval, it's considered dead
   - This can be problematic when processing individual records takes a long time

2. **Handling Record Processing Exceptions**
   - Different retry strategies might be needed
   - Some use cases require indefinite retries
   - Single-threaded model limits processing time

### Implementation Approach

The multi-threaded solution uses runnable tasks executed by a thread pool for processing records. Here's a basic implementation:

### Key Implementation Considerations

1. **Partition Processing**
   - Records from the same partition must be processed by only one thread
   - Use `KafkaConsumer.pause()` to prevent parallel processing of the same partition
   - Resume partitions only after current processing is complete

2. **Offset Management**
   - Disable automatic offset commit
   - Commit offsets manually after successful processing
   - Track offsets per partition

3. **Group Rebalancing**
   - Implement `ConsumerRebalanceListener`
   - Handle partition revocation properly
   - Ensure proper offset commits during rebalancing

While more complex to implement, the multi-threaded approach provides better resource utilization and scalability for high-throughput applications.

Kafka Consumer Performance Optimization: Thread-Per-Consumer vs Multi-Threaded Processing Guide

When building nearline data pipeline, a common pattern is creating a poller that continue polling from a message queue. Although there are lots of available tools/frameworks out there, it would still be fun to write one yourself!

Assume you are tasked with writing a poller that will keep polling a Kafka topic or AWS SQS and then apply certain operation on top of it how would you do it?

The first idea would be just doing a while loop and call poll message API like below

```python

def apply():

    your apply code

def poll():

    while True:

        messages = client.poll(timeout=1.0)

        for msg in messages:

            apply()
```

But what are the problems here. First, this is a synchronous function which means we are processing message one by one. And the poller can not move to next batch of messages until all the Apply() calls are done. In a real world example, the apply could be a time consuming jobs and our poll will simply get stuck there for hours!

What can we do with that? Maybe we can create a new thread for each of the job?

```python
def poll():
    while True:
        messages = client.poll(timeout=1.0)
        for msg in messages:
            t = threading.Thread(target = apply, args = ( ))
            t.start()    
```

This definitely help us speed up things but we may create too many threads than we want. Assume your ingestion rate is 1k/s , are we really ok with forking 1k worker threads per second!?

A more elegant way of doing this is by using Executor service with a fixed size threads pool

```

Aha, this seems much better! But what if the apply methods fail? we want to make our poll method robust so how about we provide some default try catch. This basically means our poll will call the default implementation of _process that will call your apply method in your handler

The above code is a little bit messy, maybe we could have made a poll a poller class. If we refactor our code a little bit, this is what we will have

Is there anything we can do better here? How about we add something called retry policy? For new in our _process method, we just do a simple try except block. Let's add another interface called retry policy and implement a simple linear retry

After the retry policy, we need to update how we implement our _process method

But what if the after all the retry, we still can't process the message? In this case we can either skip it or add the message to a DLQ(Dead letter Queue)

Build your message queue poller from scratch 

I want to start a series of posts about how to build a search engine from scratch. The goal of these posts will be foster discussion and learning and by no means the "only" way to implement it. I would love to learn from others who has experience building real world search engine.

## The Basic Setup

A typical search engine aims to help people do quick text search among huge amount of data. Given LinkedIn as an example, we maybe interested in posts that talks about recent Meta layoff. In order to achieve this goal, we leverage a data structure called "inverted index".

### Example: LinkedIn Posts

Assume we have the following LinkedIn posts:

### Building the Inverted Index

In order to find list of posts related to meta layoff efficiently, we want to build a term/token to post id mapping like the following. With this setup, we can quickly do a `GET("meta layoff")` query that returns the post ids: 2, 5, 11 as the result.

## Building an Online Search Service

With this basic knowledge, let's see how we can build an online service that serves the live search traffic. Assume we only have limited amount of data, here's what we can do:

1. Write some sorts of offline job (Spark/Map Reduce) that does the counting of all the posts we have and write the mapping result to a data lake storage (e.g., HDFS/S3)
2. Leverage some web framework like FastAPI to write a search resource that given a query, try to execute `dict.get()` and returns the list of post Ids and deploy it to one of the cloud providers
3. During boot up, we load the data from data lake to in memory dict

To make this scalable, we can start a fleet of instances/pods that has the same in memory data as read replica.

Voilà, you have your toy search engine! 

> **Note:** Obviously, there's many limitations of this approach. For example:
> - What if the blog post data is too big to fit into one machine's RAM?
> - Search results are not intuitive since you only get the post ids instead of actual post content.

## The Realization

Today, while working on a nearline pipeline, I had a breakthrough moment. The system required updating both a cache and data storage after polling an event from a Kafka topic. This led me to question:

> "How do I ensure data consistency between both data stores?"

The challenge was clear: you could have scenarios where:
- The cache update succeeds but the database fails
- Other service-related failures occur

After some thought, I realized the solution:

> "It's fine as long as I commit the offset after both operations are done, right?"
